Climate change affects households unevenly across both households and geographical locations, particularly in coastal urban areas such as the Special Capital Region of Jakarta (DKI Jakarta). Measuring household climate resilience requires a data-driven index that is sensitive to spatial heterogeneity, robust to outliers, and readily interpretable. Principal Component Analysis (PCA) is widely used for constructing composite indices because it reduces a large number of indicators into a smaller set of principal components. However, classical PCA has several limitations: it is sensitive to outliers, generally produces dense loading structures, and does not account for local spatial variation. Therefore, there is a need to develop a PCA method capable of simultaneously handling outliers, improving the interpretability of loading vectors, and capturing spatial heterogeneity. This study aims to develop and evaluate a geographically weighted principal component analysis that is both robust and sparse for constructing a household climate resilience index. This objective is achieved through three complementary studies. The first study compares several PCA methods, including classical PCA, robust PCA, sparse PCA, Geographically Weighted Principal Component Analysis (GWPCA), and robust GWPCA based on the Minimum Covariance Determinant (GWPCA-MCD) for constructing the Household Climate Resilience Index (HCRI). The second study develops robust GWPCA-MRCD as an extension of robust GWPCA by incorporating the Minimum Regularized Covariance Determinant (MRCD) estimator for local covariance estimation. The third study develops sparse robust GWPCA-MCD by integrating geographically weighted estimation, the MCD robust covariance estimator, and an elastic net penalty to produce sparse local loading vectors. The empirical analysis uses household survey data collected in DKI Jakarta in 2022, consisting of 221 households distributed across 17 urban villages within five administrative municipalities. Method performance is evaluated using both simulated and empirical datasets based on the proportion of variance explained by the first principal component (PC1), the distribution of PC1 scores, the stability of local covariance estimation, and the ability to produce interpretable loading structures. The simulation study considers variations in sample size, outlier proportion, bandwidth, multicollinearity level, bisquare and Gaussian kernel functions, and tuning parameters related to robustness and sparsity. The results of the first study demonstrate that outliers, loading sparsity, and spatial heterogeneity substantially influence the quality of the resulting resilience index. Robust methods are necessary to reduce the influence of outliers on the direction of the principal components, sparse methods improve the interpretability of the indicators contributing to the index, and GWPCA captures spatial variation in local principal component structures. Robust GWPCA-MCD produces stronger local PC1 dominance than classical GWPCA, highlighting the importance of robustification in local covariance structures. The results of the second study indicate that both robust GWPCA-MCD and robust GWPCA-MRCD outperform classical GWPCA. No statistically significant difference is observed between robust GWPCA-MCD and robust GWPCA-MRCD under simulation scenarios where the number of observations exceeds the number of variables (n > p). These findings indicate that MRCD achieves performance comparable to MCD under conditions favorable to MCD. Nevertheless, MRCD offers a methodological advantage by remaining applicable in more challenging local settings, particularly when the number of observations is smaller than the number of variables (n < p), when the effective local sample size is limited, or when the local covariance matrix is nearly singular. The results of the third study demonstrate that sparse robust GWPCA-MCD successfully produces local principal components that are robust, sparse, and sensitive to spatial heterogeneity. The proposed method outperforms classical GWPCA, robust GWPCA-MCD, and sparse GWPCA in terms of the proportion of variance explained by PC1. Comparisons of kernel functions show that the Gaussian kernel provides clearer performance differentiation among methods than the bisquare kernel. Consequently, the Gaussian kernel is adopted for the empirical analysis because it better represents the gradual spatial variation in household climate resilience. The use of an adaptive bandwidth is also found to be more appropriate, as it adjusts neighborhood size according to the spatial distribution of observations and yields more informative PC1 scores for HCRI stratification. The novelty of this research lies in both methodological and applied contributions. Methodologically, this study develops robust GWPCA-MRCD to improve the stability of local covariance estimation and proposes sparse robust GWPCA-MCD by integrating spatial heterogeneity, robustness to outliers, and loading sparsity within a unified local PCA framework. From an applied perspective, the proposed methods produce a robust and sparse local PCA-based Household Climate Resilience Index for DKI Jakarta. The resulting index not only provides household resilience scores but also identifies locally dominant resilience indicators and location-specific household resilience stratification. Consequently, the proposed methodology supports a more stable, interpretable, and spatially relevant assessment of household climate resilience, thereby providing a 0,95er basis for place-based climate change adaptation planning.
