Aplikasi Algoritma Faster R-CNN, SSD-MobileNet, dan YOLOv5 untuk Identifikasi dan Kuantifikasi Ikan Karang
Abstract
Terumbu karang adalah ekosistem yang sangat kompleks dan menawarkan banyak keuntungan ekologis dan ekonomis di wilayah pesisir. Akan tetapi, aktivitas manusia sekitar pantai telah menyebabkan kerusakan ekosistem terumbu karang. Salah satu indikator kesehatan ekosistem terumbu karang adalah keberadaan ikan dari famili Chaetodontidae, yang keanekaragamannya terkait erat dengan kesehatan terumbu karang, sehingga monitoring kelimpahannya dinilai penting untuk pemantauan kesejahteraan ekosistem terumbu karang. Pendekatan umum seperti Underwater Visual Census (UVC) memiliki berbagai tantangan dalam pengumpulan data ikan karang. Teknologi Deep Learning (DL) menawarkan solusi yang canggih dengan kemampuan memproses data besar dan kompleks secara otomatis. Integrasi DL dalam Autonomous Underwater Vehicles (AUV) dapat meningkatkan efisiensi pemantauan ikan karang secara real-time. Oleh karena itu, penelitian ini bertujuan untuk mengevaluasi efisiensi beberapa model DL dalam identifikasi dan kuantifikasi ikan karang menggunakan AUV, memberikan rekomendasi optimal untuk pemantauan ekosistem terumbu karang.
Penelitian dimulai dengan pengumpulan data gambar ikan spesies Chaetodontidae. Dataset dibagi menggunakan metode 10-fold cross validation untuk memastikan model yang dilatih memperoleh generalisasi yang baik. Data ini kemudian digunakan untuk melatih tiga model algoritma DL: Faster R-CNN, SSD-MobileNet, dan YOLOv5. Uji validasi dilakukan guna menentukan model dengan akurasi terbaik dari masing-masing algoritma, selanjutnya diimplementasikan secara real-time untuk perhitungan nilai framerate. Model yang paling cepat dan akurat kemudian diimplementasikan pada Raspberry Pi 4 dan diuji kembali dengan dan tanpa Coral USB Accelerator untuk melihat perbedaan kecepatan identifikasi. Hasil akhir penelitian ini memberikan rekomendasi implementasi model pada wahana AUV untuk pemantauan ekosistem terumbu karang.
Hasil dari penelitian ini menunjukkan YOLOv5 memiliki akurasi tertinggi sebesar 99,6%, diikuti oleh Faster R-CNN dengan 99,31%, dan SSD-MobileNet dengan 92,21%. Hal tersebut berbeda dalam uji kecepatan komputasi, SSD-MobileNet unggul dengan framerate 1,24 fps, lebih tinggi dibandingkan YOLOv5 dengan 0,65 fps dan Faster R-CNN dengan 0,1 fps. SSD-MobileNet dipilih karena memiliki keseimbangan akurasi dan kecepatan yang baik. Algoritma pelacakan centroid digunakan untuk menghitung ikan secara efektif. Penambahan Coral USB Accelerator pada Raspberry Pi 4 meningkatkan kecepatan komputasi hingga 10 kali lipat, menghasilkan sistem dengan kecepatan 30 fps, akurasi 87,18%, dan presisi 87,54%. Hasil ini menunjukkan bahwa teknologi ini berpotensi diaplikasikan pada AUV, khususnya dalam membantu pengumpulan data ikan secara akurat dan efisien serta mendukung penelitian bawah air dan upaya konservasi. Coral reefs are very complex ecosystems and offer many ecological and economic benefits in coastal areas. However, human activities around the coast have caused damage to the coral reef ecosystem. One indicator of the health of coral reef ecosystems is the presence of fish from the Chaetodontidae family, whose diversity is closely related to the health of coral reefs, so monitoring their abundance is considered important for monitoring the welfare of coral reef ecosystems. Common approaches such as the Underwater Visual Census (UVC) have various challenges in collecting reef fish data. Deep Learning (DL) technology offers sophisticated solutions with the ability to process large and complex data automatically. The integration of DL in Autonomous Underwater Vehicles (AUV) can increase the efficiency of real-time reef fish monitoring. Therefore, this study aims to evaluate the efficiency of several DL models in the identification and quantification of reef fish using AUV, providing optimal recommendations for monitoring coral reef ecosystems.
The research began with collecting data on images of Chaetodontidae fish species. The dataset is divided using the 10-fold cross validation method to ensure the trained model obtains good generalization. This data is then used to train three DL algorithm models: Faster R-CNN, SSD-MobileNet, and YOLOv5. Validation tests are carried out to determine the model with the best accuracy for each algorithm, then implemented in real-time to calculate framerate values. The fastest and most accurate model was then implemented on a Raspberry Pi 4 and tested again with and without Coral USB Accelerator to see the difference in identification speed. The final results of this research provide recommendations for implementing models on AUV vehicles for monitoring coral reef ecosystems.
The results of this research show that YOLOv5 has the highest accuracy at 99.6%, followed by Faster R-CNN with 99.31%, and SSD-MobileNet with 92.21%. This is different in the computing speed test, SSD-MobileNet is superior with a framerate of 1.24 fps, higher than YOLOv5 with 0.65 fps and Faster R-CNN with 0.1 fps. SSD-MobileNet was chosen because it has a good balance of accuracy and speed. A centroid tracking algorithm is used to count fish effectively. The addition of Coral USB Accelerator to the Raspberry Pi 4 increases computing speed by 10 times, resulting in a system with a speed of 30 fps, 87.18% accuracy, and 87.54% precision. These results show that this technology has the potential to be applied to AUVs, particularly in helping to collect fish data accurately and efficiently and supporting underwater research and conservation efforts.
