Analisis Multivariat dan Pemodelan Hotspot Berdasarkan Indikator Iklim di Kalimantan Menggunakan Copula

Indonesia adalah negara dengan wilayah hutan yang sangat luas. Namun demikian, sejak beberapa dekade terakhir, kawasan hutan di Indonesia mengalami degradasi yang sangat serius dari segi kuantitas maupun kualitas. Salah satu faktor yang menyebabkan deforestasi tersebut adalah kebakaran hutan. Kebakaran hutan dan lahan yang terjadi setiap tahun telah menjadi isu nasional yang mendapat perhatian serius dari pemerintah maupun peneliti, khususnya di pulau Kalimantan. Faktor alam seperti El Niño dapat mengakibatkan berkurangnya curah hujan dan memperpanjang musim kemarau sehingga tanaman menjadi lebih kering dan mudah terbakar. Beberapa kebakaran hebat seperti pada tahun 1997 dan 2015 terjadi bertepatan dengan El Niño kuat.
Pada saat ini, kebutuhan akan suatu model risiko kebakaran menjadi sangat penting dalam upaya meningkatkan sistem peringatan dini kebakaran hutan dan lahan di Indonesia. Sebagai langkah awal untuk mengembangkan model tersebut, diperlukan konsep tentang distribusi bersama. Salah satu pendekatan yang sering digunakan untuk menghitung distribusi bersama tersebut adalah copula. Copula sering diterapkan pada bidang keuangan, tetapi masih sangat sedikit penerapannya dalam bidang klimatologi, khususnya analisis tentang kebakaran hutan.
Berdasarkan uraian tersebut, penelitian ini bertujuan menganalisis distribusi bersama berbasis copula antar indikator iklim maupun antara indikator iklim dan hotspot di Kalimantan, beserta perubahannya akibat pengaruh musim dan kondisi ENSO. Selanjutnya, berdasarkan distribusi bersama yang diperoleh, dibangun suatu model regresi berbasis copula untuk hotspot di Kalimantan jika diketahui indikator iklim dan kondisi ENSO yang spesifik.
Penelitian ini diawali dengan mendefinisikan area rentan kebakaran di pulau Kalimantan menggunakan k-mean clustering untuk mengeliminasi daerah dengan tingkat kebakaran yang rendah. Berdasarkan hasil analisis dependensi dari masing-masing indikator iklim terhadap hotspot di area rentan kebakaran, diperoleh bahwa rataan curah hujan dua bulanan, anomali curah hujan bulanan, dan jumlah hari tanpa hujan tiga bulanan memberikan korelasi moderat untuk hotspot di Kalimantan. Data tersebut yang kemudian disebut sebagai rataan curah hujan, anomali curah hujan, dan hari tanpa hujan pada proses analisis selanjutnya.
Hasil fitting parameter copula antar indikator iklim menunjukkan bahwa copula Galambos dan Gumbel asimetris merupakan copula yang paling cocok, masing-masing untuk kasus bivariat (hari tanpa hujan dan rataan curah hujan) dan trivariat (hari tanpa hujan, rataan curah hujan, dan anomali curah hujan). Distribusi bersama antara hari tanpa hujan dan rataan curah hujan menunjukkan kondisi kekeringan terburuk pada tahun 2019 lebih buruk daripada tahun 2015. Namun, dampak kekeringan pada tahun 2015 lebih terasa karena musim kemarau tahun 2015 lebih lama daripada tahun 2019. Meskipun memiliki hotspot yang hampir sama (pada bulan September), tetapi jumlah hotspot pada bulan Agustus dan Oktober jauh lebih tinggi pada tahun 2015. Berdasarkan periode ulang bersama, kemungkinan bahwa satu bulan lebih parah daripada bulan September 2019 (baik hari tanpa hujan dan rataan curah hujan) adalah 1/78 bulan jika diasumsikan kondisi iklim stasioner. Namun, kemungkinan tersebut sangat tidak pasti dikarenakan data yang terbatas.
Setelah data direduksi berdasarkan musim dan kondisi ENSO, diperoleh bahwa kondisi El Niño dan La Niña tidak berpengaruh signifikan terhadap distribusi bersama antar indikator iklim pada musim hujan. Hasil tersebut menunjukkan bahwa selain rataan curah hujan, kondisi hari tanpa hujan dan anomali curah hujan juga tidak terpengaruh oleh kondisi ENSO pada musim hujan. Sebaliknya, El Niño dan La Niña berpengaruh signifikan terhadap distribusi bersama pada musim kemarau. El Niño meningkatkan peluang situasi kering yang terjadi secara bersamaan pada indikator iklim hampir dua kali lipat dibandingkan kondisi ENSO normal. Sebaliknya, selama kondisi La Niña, peluang situasi kering yang terjadi secara bersamaan pada indikator iklim berkurang lebih dari setengah dari peluang selama kondisi ENSO normal.
Sementara itu, hasil fitting parameter copula antara indikator iklim dan hotspot menunjukkan bahwa fungsi copula yang paling cocok untuk rataan curah hujan – hotspot dan hari tanpa hujan – hotspot adalah sama, yaitu copula Joe, Galambos, dan BB1 masing-masing untuk kondisi La Niña, normal, dan El Niño. Berdasarkan fungsi kepekatan peluang bersama dan fungsi survival bersyarat, terdapat anomali pada kondisi ENSO normal yang memiliki hotspot lebih banyak dari biasanya, yaitu pada bulan September 2019. Anomali ini sangat jarang terjadi, ditunjukkan dengan periode ulang bersama antara rataan curah hujan dan hotspot, yaitu 296 bulan dengan selang kepercayaan 95% [51, ∞] bulan dan periode ulang bersama antara hari tanpa hujan dan hotspot, yaitu 366 bulan dengan selang kepercayaan 95% [61, ∞] bulan. Fungsi survival bersyarat dengan diberikan kondisi kering pada indikator iklim memperkuat pernyataan ini. Peluang hotspot yang lebih parah dari tahun 2019 sangat rendah selama kondisi ENSO normal, yaitu kurang dari 2%. Satu-satunya kondisi ENSO dengan peluang yang relatif tinggi adalah pada saat El Niño, yaitu lebih dari 10%. Sementara itu, peluang hotspot yang lebih parah dari tahun 2019 saat La Niña sangat rendah, hampir mendekati nol.
Tahap terakhir dari penelitian ini adalah membangun suatu model regresi berbasis copula untuk hotspot berdasarkan sebaran bersamanya. Model regresi copula menunjukkan bahwa model dengan hari tanpa hujan sebagai indikator iklim lebih baik daripada model dengan rataan curah hujan sebagai indikator iklim, yang ditunjukkan oleh nilai RMSE dan R^2 yang lebih baik. Regresi copula untuk hotspot yang diberikan rataan curah hujan spesifik dan kondisi ENSO memiliki nilai RMSE 1339 hotspot dan nilai R^2 60.70%. Sementara itu, regresi copula untuk hotspot yang diberikan hari tanpa hujan spesifik dan kondisi ENSO memiliki nilai RMSE sebesar 1185 hotspot dan nilai R^2 sebesar 69.21%. Secara keseluruhan, model regresi copula dengan diberikan hari tanpa hujan spesifik lebih fit hampir setiap tahun, terutama pada tahun 2004, 2006, 2014, 2015, dan 2019. Sebaliknya, model regresi copula dengan diberikan rataan curah hujan spesifik lebih fit hanya pada tahun 2002 dibandingkan model regresi copula dengan diberikan hari tanpa hujan. Indonesia is a country with a vast forest area. However, since the last few decades, forest areas in Indonesia have experienced severe degradation in terms of both quantity and quality. One of the factors that cause deforestation is forest and land fires. Forest and land fires that occur every year, especially in Kalimantan, have become a national issue that gets serious attention from government and researchers. Natural factors such as El Niño can reduce rainfall and prolong the dry season so that plants become drier and more prone to fire. Several severe fires, such as in 1997 and 2015, occurred to coincide with strong El Niño.
At this time, a fire risk model is essential to improve an early warning system of forest and land fires in Indonesia. As a first step to develop the model, a concept of joint distribution is needed. One approach that is often used to construct the joint distribution is copula. Copula is often applied in the financial sector, but there is still very little application in climatology, especially in the analysis of forest fires.
Based on this description, this study aims to analyze copula-based joint distribution between climate indicators also between climate indicators and hotspots in Kalimantan, along with changes due to the influence of seasonality and ENSO condition. Furthermore, based on the joint distribution obtained, a copula-based regression model is constructed for hotspots in Kalimantan if specific climate indicators and ENSO conditions are known.
This study begins by defining fire-prone areas on the island of Kalimantan using k-mean clustering to eliminate areas with low fire rates. Based on the results of the dependency analysis, it is found that the bi-monthly average rainfall, monthly rainfall anomalies, and three-monthly dry spells provide a moderate correlation for hotspots in Kalimantan. These data are then referred to as average rainfall, rainfall anomalies, and dry spells in the following analysis process.
The results of fitting the copula parameters between climate indicators show that the Galambos and asymmetric Gumbel copulas are the most suitable copulas for bivariate (dry spells and average rainfall) and trivariate (dry spells, average rainfall, and rainfall anomaly) cases, respectively. The joint distribution between dry spells and average rainfall shows that the worst drought conditions in 2019 were worse than the worst drought conditions in 2015. However, the impact of the 2015 severe drought was more pronounced because the dry season in 2015 was longer than in 2019. Despite having almost the same hotspots (in September), the number of hotspots in August and October was much higher in 2015. Based on the joint return period, the probability that a month is worse than September 2019 (both dry spells and average rainfall) is 1/78 months if conditions are assumed stationary climate. However, this probability is highly uncertain due to limited data.
After reducing data based on the season and ENSO conditions, it is found that El Niño and La Niña conditions have no significant effect on the joint distribution of climate indicators during the rainy season. These results indicate that in addition to the average rainfall, the condition of dry spells and rainfall anomalies are also not affected by ENSO conditions during the rainy season. On the other hand, El Niño and La Niña significantly affect the joint distribution in the dry season. El Niño increases the probability of a concomitant dry situation on climate indicators almost twice as much as normal ENSO conditions. On the other hand, during La Niña, the probability of a dry situation co-occurring on the climate indicator is reduced by more than half of the probability during normal ENSO conditions.
Meanwhile, the results of fitting the copula parameters between climate indicators and hotspots show that the most suitable copula functions for the average rainfall – hotspot and dry spells – hotspot are the same, i.e., Joe, Galambos, and BB1 copulas during La Niña, normal, and El Niño, respectively. Based on the joint probability density and conditional survival function, there is an anomaly in normal ENSO conditions with more hotspots than usual in September 2019. This anomaly is very rare, as indicated by the joint return period between the average rainfall and hotspot, which is 296 months with a 95% confidence interval [51, ∞] months and a concurrent return period between dry spells and hotspots, which is 366 months with a 95% confidence interval [61, ∞] months. The conditional survival function given dry conditions on climate indicators strengthens this statement. The probability of a hotspot being more severe than 2019 is very low during normal ENSO conditions, less than 2%. The only ENSO condition with a relatively high probability is during El Niño, more than 10%. Meanwhile, the probability of a hotspot being more severe than in 2019 when La Niña was very low is close to zero.
The last stage of this research is to construct a copula-based regression model based on its joint distribution. The results of copula regression model show that the model with dry spells as a climate indicator is better than the model with the average rainfall as a climate indicator, which is indicated by better RMSE and R^2 values. Copula regression for hotspots given the specific rainfall average and ENSO conditions has an RMSE value of 1339 and an R^2 value of 60.70%. Meanwhile, the copula regression for hotspots given specific dry spells and ENSO conditions has an RMSE value of 1185 and an R^2 value of 69.21%. Overall, the copula regression model given specific dry spells fits almost every year, especially in 2004, 2006, 2014, 2015, and 2019. In contrast, given the specific rainfall average, the copula regression model is more fit only in 2002 than the copula regression model with given dry spells.
